Let's see how I did it! πŸ”

Tools and Libraries Used πŸ› οΈ:

  • Pandas 🐼
  • NumPy πŸ”’
  • SciPy πŸ“ˆ
  • Matplotlib πŸ“Š
  • Seaborn 🌊
  • Scikit-learn 🧠
  • Imbalanced-learn βš–οΈ
  • XGBoost 🌳
  • LightGBM 🌟

Data πŸ“Š:

The data used in this project were sourced by kaggle:

EDA πŸ•΅οΈβ€β™€οΈ:

During this stage, I delved deep into the data performing univariate, bivariate, and multivariate analysis, during which I identified a lot of outliers in four of the columns, as seen below:

Outlier Dashboard

Outlier Detection and Handling πŸ›‘οΈ:

For detecting the outliers, I used an ensemble technique using:

  • Modified Z-score
  • IQR
  • Isolation Forest

Isolation Forest Example

Zscore was not used due to high skewness in variables.

Models turned out to perform better without outlier handling! πŸ“ˆ

Data Preprocessing πŸ› οΈ:

During this stage, I made sure to avoid data leakage by creating my train, evaluation, and test datasets before doing any preprocessing. This process was done in the following steps:

  1. Data Imputing: Replaced 'Unknown' values in three columns with the mode of the columns (Reduced model complexity and results were improved slightly).
  2. Feature Engineering: Experimented with creating/categorizing features to improve model performance.
  3. Feature Transformations: Applied transformations to columns to reduce skewness. Example implementation: Transformation Example
  4. Encoding: Label encoded variables with a real-life order to them and One-Hot-Encoded purely categorical ones.
  5. Scaling: Utilized sklearn MinMaxScaler for scaling all numerical variables.
  6. Feature Selection: In this stage, I tried to reduce dimensionality using techniques such as correlations, dendrogram analysis, and variance threshold.
  • Correlations Correlation Matrix

  • Dendrogram Analysis Dendrogram

  • Variance Threshold

Clustering 🧩:

Models used:

  • KMeans
  • AgglomerativeClustering
  • DBSCAN

Ended up using KMeans for its ease of use and interpetability, since all of them had similar performance.

Evaluation Metrics:

  • Inertia
  • Silhouette Score
  • Calinski-Harabasz Score
  • Davies-Bouldin Score

Optimal number of clusters turned out to be 4! 🎯

Cluster Metrics

Clustering didn't directly lead to actionable insights, but provided valuable observations: πŸ”

  • Men are generally wealthier and spend more responsibly.

  • Marital Status and Education are not statistically important indicators of wealth or spending habits.

Mean Feature Values for each cluster:

Customer Churn πŸ’Ό:

Before fitting the model, SMOTE was applied to tackle imbalanced target variable! βš–οΈ

SMOTE Implementation

Models used:

  • LogisticRegression
  • RandomForest
  • XGBClassifier
  • LGBMClassifier
  • Ensemble techniques with the above models

Best Models πŸ’»:

Model Class 1 Recall Class 1 F1 Accuracy
Base XGBoost 0.89 0.91 0.97
Best XGBClassifier 0.92 0.87 0.96
Ensemble Tuned Models 0.9 0.89 0.96

Model to pick:

  • Best XGB, for identifying as much churners as possible.

  • Base XGB, for an overall well-rounded model performance

  • Ensemble Tuned Models, for a well-rounded performance weighted towards identifying more churners

Evaluation Metrics:

  • Precision
  • Recall
  • F1-score
  • Accuracy

Emphasis was on Recall due to the nature of the problem, leading to over 90% recall and 97% overall accuracy! πŸŽ―πŸš€
